This always comes up as a Van Gogh quote but I think it’s fake. Can someone confirm one way or another?

I cannot. I can say that I have read his letters to his brother a dozen times (an abridged version) and do not remember that quote.
But man, what letters! I cannot recommend them strongly enough.
